Zero-Shot Learning

Zero-shot learning is the ability of an AI model to perform tasks it has never explicitly been trained on, relying on general knowledge and reasoning rather than task-specific examples.

Traditional machine learning requires labeled examples for every task: to classify emails, you need thousands of labeled email examples. Zero-shot learning breaks this constraint. Large language models trained on vast text corpora develop general reasoning capabilities that transfer to novel tasks described in natural language. You can ask a zero-shot model to classify emails into categories it has never seen before, simply by describing what each category means. Zero-shot capabilities emerged as a surprising property of scale. Smaller models require few-shot examples to perform well on new tasks. Sufficiently large models can follow task descriptions without any examples. This property is central to why LLMs are so useful: you can deploy them on new tasks immediately without data collection and labeling. In classification tasks, zero-shot learning typically works by having the model evaluate how well each candidate label matches the input. In generation tasks, it works by providing clear task instructions. The quality of zero-shot performance depends heavily on how well the task is described and how related it is to the model's training distribution. Zero-shot learning is closely related to in-context learning and instruction following. Modern LLMs that have been instruction-fine-tuned are particularly good at zero-shot tasks because they have been trained to interpret and follow novel instructions reliably.
